Chapter 7. Profiling and Tuning GPU Memory Access Patterns

As AI models grow in size and complexity, a GPU’s memory system often becomes the bottleneck that stands between theoretical compute capability and real-world performance. As you saw in Chapter 6, modern NVIDIA GPUs combine thousands of simple, throughput-optimized cores with specialized Tensor Cores. They also include high-bandwidth memory (HBM), coherent CPU-GPU unified memory address space (e.g., Grace Blackwell Superchip), on-chip shared memory, caches, and specialized direct memory access (DMA) engines like the Tensor Memory Accelerator (TMA).

In this chapter, you’ll see various CUDA C++ and PyTorch optimization techniques to align data structures for efficient memory access, eliminate redundant data loads, and overlap data transfers with computation using hardware.

Through concrete before-and-after examples of matrix multiplies, tensor operations, and more, you’ll see how small changes in memory access patterns, tiling strategies, and asynchronous data transfers can reduce wasted bandwidth, boost arithmetic efficiency, and transform kernels from memory bound to compute bound.

By the end of this chapter, you’ll know how to write CUDA kernels that can better utilize the GPU’s memory hierarchy and hardware-optimized data transfer engines.
